Problem
Quantization overhead (quantize/dequantize kernels) and calibration data cost made quantization of large models uneconomic in practice.
Mechanism
Three-component pipeline: (1) fine-grained hardware-friendly group-wise quantization with per-group scales and asymmetric quantization to halve scale overhead; (2) layer-by-layer knowledge distillation (LKD) that needs no original training data - the teacher is the unquantized layer and the calibration inputs are synthetic activations propagated forward from layer 0; (3) a custom quantization system backend that fuses quant/dequant into the matmul to remove the runtime overhead.
Speedup reported
Paper's own claim (abstract): INT8 weights+activations at 'cost-free' accuracy impact with up to 5.19x (BERT) and 4.16x (GPT-3 style) speedup vs FP16 inference; adding LKD gives INT4 fully-connected + INT8 attention with 3x memory-footprint reduction vs FP16. COMPRESSION RATIO: 8x for the W8A8 config, ~4x for the mixed INT4/INT8 config. QUALITY COST: described as 'minimal accuracy impact' - not quantified in the abstract. Hardware in the paper is the authors' own custom INT8 kernels, which is precisely why this did not become a production default: no general-purpose kernel ships it.
notes
arXiv ID 2206.01861 verified via /abs/; single version. Venue NeurIPS 2022 from Semantic Scholar. Year = venue year 2022. adoption=research-only: the speedups depend on a bespoke quantization system backend (Triton INT8 kernels) that no upstream engine adopted; SmoothQuant/GPTQ achieved the same INT8 regime with hardware-native operators instead. arXiv ID and title verified by fetching https://arxiv.org/abs/2206.01861 and reading the citation_title meta tag on 2026-10-03. Venue and year from the Semantic Scholar graph API batch endpoint (paper/arXiv:2206.01861) unless the record's notes say otherwise. VENUE_TRACK BACKFILL 2026-10-04 (paper-fields pass, agent w3p): venue_track 'main'. This is STRUCTURAL rather than researched: neurips has no Findings volume and no workshop track in which a paper could appear, so 'main' is the only possible honest value and no per-paper evidence was needed. The field is annotated here so that 'findings' and 'workshop' remain MEANINGFUL - a filter for findings=true must return only the papers that actually are findings, which requires every other paper to be explicitly NOT findings.
